Voxel R-CNN: Towards High Performance Voxel-based 3D Object Detection
Open accessAbstract
Recent advances on 3D object detection heavily rely on how the 3D data are represented, i.e., voxel-based or point-based representation. Many existing high performance 3D detectors are point-based because this structure can better retain precise point positions. Nevertheless, point-level features lead to high computation overheads due to unordered storage. In contrast, the voxel-based structure is better suited for feature extraction but often yields lower accuracy because the input data are divided into grids. In this paper, we take a slightly different viewpoint --- we find that precise positioning of raw points is not essential for high performance 3D object detection and that the coarse voxel granularity can also offer sufficient detection accuracy. Bearing this view in mind, we devise a simple but effective voxel-based framework, named Voxel R-CNN. By taking full advantage of voxel features in a two-stage approach, our method achieves comparable detection accuracy with state-of-the-art point-based models, but at a fraction of the computation cost. Voxel R-CNN consists of a 3D backbone network, a 2D bird-eye-view (BEV) Region Proposal Network, and a detect head. A voxel RoI pooling is devised to extract RoI features directly from voxel features for further refinement. Extensive experiments are conducted on the widely used KITTI Dataset and the more recent Waymo Open Dataset. Our results show that compared to existing voxel-based methods, Voxel R-CNN delivers a higher detection accuracy while maintaining a real-time frame processing rate, i.e., at a speed of 25 FPS on an NVIDIA RTX 2080 Ti GPU. The code is available at https://github.com/djiajunustc/Voxel-R-CNN.

TL;DR
Voxel R-CNN is a two-stage voxel-based 3D detector that directly extracts RoI features from 3D voxel feature volumes via voxel RoI pooling, achieving accuracy comparable to point-based detectors at lower computation. On KITTI test it reaches 81.62% moderate AP for car at 25.2 FPS, and on Waymo Open Dataset it reaches 75.59% LEVEL 1 3D mAP.
Key findings
- On the KITTI test set, Voxel R-CNN achieves 90.90/81.62/77.06 AP3D for easy/moderate/hard car at 25.2 FPS, outperforming SA-SSD by 2.15/1.83/2.90 absolute improvements and matching PV-RCNN with about 1/3 running time.
- On the KITTI val set with 11 recall positions, Voxel R-CNN achieves 89.41/84.52/78.93 AP3D for easy/moderate/hard car, with the best moderate and hard results in the comparison.
- On the Waymo Open Dataset validation set, Voxel R-CNN achieves 75.59% LEVEL 1 3D mAP and 88.19% LEVEL 1 BEV mAP, outperforming PV-RCNN by 5.29% mAP on LEVEL 1 3D and by +10.98% mAP in the 50m-Inf range.
- Ablation shows adding a detect head to the BEV baseline boosts moderate AP by 4.22%; voxel query improves FPS by 1.7; the accelerated PointNet module boosts FPS from 17.4 to 21.4; the final model reaches 84.52 moderate AP at 25.2 FPS.
Methods
- Voxel R-CNN is a two-stage voxel-based framework: a 3D backbone, a 2D BEV backbone with RPN, and a detect head with voxel RoI pooling. Voxel RoI pooling divides each proposal into a 6×6×6 grid, uses voxel query with Manhattan distance thresholds 2 and 4, and aggregates neighboring voxel features with an accelerated PointNet module.
- Experiments use KITTI (7481 training, 7518 testing; train/val split 3712/3769) and Waymo Open Dataset (798 training sequences, ~158k samples; 202 validation sequences, ~40k samples), evaluating car/vehicle detection with AP/mAP at IoU 0.7.
- Training uses Adam; KITTI is trained for 80 epochs with batch size 16, Waymo for 30 epochs with batch size 32, learning rate 0.01 with cosine annealing. Inference applies NMS with IoU 0.7 and keeps top-100 proposals, then NMS with IoU 0.1 after refinement.
Limitations
- The paper does not include a dedicated limitations section. It acknowledges that voxelization often causes loss of precise position information, though it argues this is not essential for high performance 3D object detection.
- Evident from the text: evaluation focuses on car/vehicle detection on KITTI and Waymo, with no pedestrian or cyclist results reported.
- Evident from the text: performance is tied to specific voxel sizes and point-cloud clipping ranges, and no failure-case or robustness analysis is provided.

About these checks
Registry, retraction, Cites and statistics results are computed, not judged, with one exception: a printed reference that no index lists is read once by a model before it counts as a citation error. Claims are extracted by a model and kept only when their quote appears verbatim in the text; each cited source is then checked, with a model’s help, for whether it says what the claim relies on. Those verdicts can be wrong — read the claim’s quote and the cited source before relying on one.
Claims read by deepseek-v4.1-flash under definition version 3 (extract-v3) on 2026-10-08.
Classified by jev-1.13-20260917 (gold-guideline-v0.2) on 2026-10-08.
Statistics and arithmetic are recomputed, not judged.
Confidence bands are shown only for fields calibrated on our annotated test set. None is calibrated yet, so no band is shown.
