EvoAgentX: An Automated Framework for Evolving Agentic Workflows

Open access

Abstract

Multi-agent systems (MAS) have emerged as a powerful paradigm for orchestrating large language models (LLMs) and specialized tools to collaboratively address complex tasks. However, existing MAS frameworks often require manual workflow configuration and lack native support for dynamic evolution and performance optimization. In addition, many MAS optimization algorithms are not integrated into a unified framework. In this paper, we present EvoA-gentX, an open-source platform that automates the generation, execution, and evolutionary optimization of multi-agent workflows.EvoA-gentX employs a modular architecture consisting of five core layers: the basic components, agent, workflow, evolving, and evaluation layers.Specifically, within the evolving layer, EvoAgentX integrates three MAS optimization algorithms, TextGrad, AFlow, and MIPRO, to iteratively refine agent prompts, tool configurations, and workflow topologies. We evaluate EvoAgentX on HotPotQA, MBPP, and MATH for multi-hop reasoning, code generation, and mathematical problem solving, respectively, and further assess it on real-world tasks using GAIA.Experimental results show that EvoAgentX consistently achieves significant performance improvements, including a 7.44% increase in HotPotQA F1, a 10.00% improvement in MBPP pass@1, a 10.00% gain in MATH solve accuracy, and an overall accuracy improvement of up to 20.00% on GAIA.The source code is available at: https://github. com/EvoAgentX/EvoAgentX.

TL;DR

EvoAgentX is an open-source platform that automates generation, execution, evaluation, and evolutionary optimization of multi-agent workflows through five modular layers. It integrates TextGrad, AFlow, and MIPRO to iteratively refine prompts, tool configurations, and workflow topologies, reporting consistent gains on HotPotQA, MBPP, MATH, and GAIA.

Key findings

  • TextGrad increased HotPotQA F1 from 63.58% to 71.02%, AFlow raised MBPP pass@1 from 69.00% to 79.00%, and TextGrad improved MATH solve rate from 66.00% to 76.00%.
  • MIPRO also improved over original performance: HotPotQA F1 69.16%, MBPP pass@1 68.00%, and MATH solve rate 72.30%.
  • On GAIA, EvoAgentX improved Open Deep Research overall accuracy by 18.41% (Level 1 +20.00%, Level 2 +8.71%, Level 3 +7.69%) and OWL overall accuracy by 20.00% (Level 1 +28.57%, Level 2 +10.00%, Level 3 +100.00%).
  • The paper reports that EvoAgentX consistently enhances performance across multi-hop reasoning, code generation, mathematical problem solving, and real-world multi-agent tasks.

Methods

  • EvoAgentX uses a five-layer modular architecture: basic components, agent, workflow, evolving, and evaluation; the evolving layer integrates TextGrad, AFlow, and MIPRO for agent, workflow, and memory optimization.
  • Evaluation used HotPotQA for multi-hop QA, MBPP for Python code generation, MATH for high-school math, and GAIA for real-world multi-agent tasks, with metrics including F1, pass@1, solve rate, and accuracy.
  • For GAIA, the authors applied EvoAgentX to refine agent prompts and workflow configurations of two open-source frameworks from the GAIA leaderboard: Open Deep Research and OWL.

Limitations

  • The paper states that the memory optimizer “remains under active development” and lists future work to extend EvoAgentX with more optimization algorithms, richer tool integration, long-term memory, and advanced evolution strategies.
  • The paper does not include a dedicated limitations section; evident from the text, the evaluation reports improvements on selected benchmarks and two GAIA frameworks without reporting statistical significance, variance, or full hyperparameter/ablation details in the main text.

Constructing a multi-agent system typically requires manual efforts in defining roles, specifying task decomposition strategies, designing agent interactions, and configuring execution workflows.

“Despite these promising developments, constructing a multi-agent system typically requires manual efforts in defining the roles of agents, specifying task decomposition strategies, designing agent interactions, and configuring execution workflows (Tang et al., 2024;Xiao et al., 2024).”

The Introduction (p. 1) says DSPy composes modular operators and automatically generates optimized LM strategies and prompts; the Abstract (p. 1) also says it can optimize pipelines that control agent loops. They do not establish that DSPy is fragmented or absent from a unified platform; the paper instead presents DSPy as a systematic framework. This source does not address TextGrad. (LLM, conf=0.86)

About these checks

Registry, retraction, Cites and statistics results are computed, not judged, with one exception: a printed reference that no index lists is read once by a model before it counts as a citation error.
