Abstract

While recent years have witnessed a rapid growth of research papers on recommender system (RS) , most of the papers focus on inventing machine learning models to better fit user behavior data. However, user behavior data is observational rather than experimental. This makes various biases widely exist in the data, including but not limited to selection bias, position bias, exposure bias, and popularity bias. Blindly fitting the data without considering the inherent biases will result in many serious issues, e.g., the discrepancy between offline evaluation and online metrics, hurting user satisfaction and trust on the recommendation service, and so on. To transform the large volume of research models into practical improvements, it is highly urgent to explore the impacts of the biases and perform debiasing when necessary. When reviewing the papers that consider biases in RS, we find that, to our surprise, the studies are rather fragmented and lack a systematic organization. The terminology “bias” is widely used in the literature, but its definition is usually vague and even inconsistent across papers. This motivates us to provide a systematic survey of existing work on RS biases. In this paper, we first summarize seven types of biases in recommendation, along with their definitions and characteristics. We then provide a taxonomy to position and organize the existing work on recommendation debiasing. Finally, we identify some open challenges and envision some future directions, with the hope of inspiring more research work on this important yet less investigated topic. The summary of debiasing methods reviewed in this survey can be found at https://github.com/jiawei-chen/RecDebiasing .

  • Typically, bias in recommender systems is observational rather than experimental, as it collects user interaction data to execute simulations within the system.

“Typically, bias in RS is observational rather than experimental, as it collects user interaction data to execute simulations within the system [7, 52].”

From A Deep Dive into Fairness, Bias, Threats, and Privacy in Recommender Systems: Insights and Future Research (2024) · cites this paper as [7]

Section 3.1.1 says that data collection in recommender systems is typically observational rather than experimental, and Section 3.1 identifies the data as user interactions. The paper describes the data—not bias itself—as observational, and these passages do not support the claim that the data are collected to execute simulations within the system. (LLM, conf=0.87)

  • Popularity bias reduces the level of personalized recommendations and amplifies the Matthew effect, where popular items become even more popular due to increased exposure.

“This reduces the level of personalized recommendations and amplifies the Matthew effect, where popular items become even more popular due to increased exposure [7, 75].”
  • Social factors heavily influence conformity bias, as users often mimic their friends' behaviours or suppress negative opinions after seeing the prevalence of positive public comments.

“Social factors heavily influence it, as users often mimic their friends' behaviours [64, 65] or suppress negative opinions after seeing the prevalence of positive public comments [7].”
  • The feedback loop of bias operates according to the Matthew effect, meaning 'the rich get richer'.

“This feedback loop operates according to the Matthew effect, meaning “the rich get richer” [7].”
  • Implicit feedback can contribute to exposure bias because it comprises partial positive interaction data between users and items.

“Implicit feedback can contribute to exposure bias since it comprises partial positive interaction data between users and items [7].”

About these checks

Registry, retraction, Cites and statistics results are computed, not judged, with one exception: a printed reference that no index lists is read once by a model before it counts as a citation error. Claims are extracted by a model and kept only when their quote appears verbatim in the text; each cited source is then checked, with a model’s help, for whether it says what the claim relies on. Those verdicts can be wrong — read the claim’s quote and the cited source before relying on one.

Statistics and arithmetic are recomputed, not judged.

Confidence bands are shown only for fields calibrated on our annotated test set. None is calibrated yet, so no band is shown.
