TL;DR
This review surveys federated learning (FL), covering its characteristics, open-source frameworks, optimization and security evolution, and applications in mobile/IoT, industrial engineering, and healthcare. It identifies six research fronts—asynchronous training, gradient aggregation, incentive mechanisms, returned-model verification, blockchain integration, and unsupervised federated learning—to guide future landing applications.
Key findings
- FL is a decentralized privacy-preserving collaborative machine learning scheme, categorized into horizontal FL, vertical FL, and federated transfer learning. Two mainstream open-source frameworks are TensorFlow Federated (TFF), which integrates FedAvg and Secure Aggregation and has been implemented over ten million devices with hope to scale to billions, and FATE, described as the first open-source industrial-level framework for cross-organizational architecture using homomorphic encryption and secure multiparty computing.
- The main optimization challenges are high communication cost, statistical heterogeneity, and structural heterogeneity; reviewed evolution paths include reducing communication rounds, decreasing model update time, handling non-IID data, fault tolerance, and resource allocation.
- Security analysis covers data poisoning, model poisoning/adversarial attacks, and inferring attacks; privacy-preserving methods include differential privacy, homomorphic encryption, locality-sensitive hashing, secure aggregation, and hybrid approaches.
- Applications span mobile keyboards/emoji prediction, mobile edge computing, smart home IoT, robots, environmental monitoring, visual inspection, UAV attack detection, electric vehicle energy prediction, credit card fraud detection (reported as average test AUC 10% higher than traditional method), and healthcare tasks such as EMR phenotyping, mortality prediction, patient similarity, EEG classification, and MRI analysis.
Methods
- Design: literature review with citation analysis, reviewing FL literature to summarize characteristics, challenges, optimization and security evolution, and applications in industrial engineering and computer science.
- Data or sample: no systematic sample size or search protocol is stated; the review draws on cited FL studies and applications, with Table 1 summarizing application domains, pros, and constraints.
- Main analysis: narrative synthesis organized by FL overview, evolution/optimization, security, applications, and future work; figures use line thickness to show reference frequency of papers in Google Scholar.
Limitations
- Paper-stated limitations of FL: current FL mainly contributes to horizontally collaborative training for landing applications; existing federal training mostly bases on a small set of organizations and is not able to extend to collaborative training for huge numbers of devices or institutions; vertical FL and federated transfer learning still have room for improvement; communication efficiency remains an issue in federated transfer learning.
- Evident limitations of the review: no explicit systematic search strategy, inclusion/exclusion criteria, or quality appraisal are reported; no quantitative meta-analysis is performed; reliance on selected literature and Google Scholar reference-frequency visualization may introduce selection or coverage bias.
- Paper-stated application constraints from Table 1 include high communication cost, limited robustness to background noise, inability to be used for several edge clouds, extra communication overhead, and convergence requiring more iterations, among others.

About these checks
Registry, retraction, Cites and statistics results are computed, not judged, with one exception: a printed reference that no index lists is read once by a model before it counts as a citation error. Claims are extracted by a model and kept only when their quote appears verbatim in the text; each cited source is then checked, with a model’s help, for whether it says what the claim relies on. Those verdicts can be wrong — read the claim’s quote and the cited source before relying on one.
Claims read by deepseek-v4.1-flash under definition version 3 (extract-v3) on 2026-10-09.
Classified by jev-1.13-20260917 (gold-guideline-v0.2) on 2026-10-09.
Statistics and arithmetic are recomputed, not judged.
Confidence bands are shown only for fields calibrated on our annotated test set. None is calibrated yet, so no band is shown.
